How do the taxes differ from Canadians and Americans here? Is there any way to file late (really late, like say for last year)?

No, it's not true. E2Visa holders all pay taxes. This guy's school was probably just not withholding taxes at all.

It can be true if you are working for a PUBLIC educational institution.

Public school teachers, PUBLIC college teachers and PUBLIC university profs who are NOT Canadian can be exempted from paying taxes for the first 2 years in Korea.

They must however show that they are still considered resident (and possibly taxable) in their home country.

People working at PRIVATE educational facilities such as language academies (hakwons), private colleges or universities and their institutes are NOT tax exempt.

AND, yes, you can file late. For help and information contact the Foreign Taxpayer Advocate Service at:
